AI Agents & RAG: Production Architecture with Next.js

AI Agents and RAG: Reference Architectures, Tooling, and Pitfalls

Enterprises want AI that answers with context, cites sources, and can act. Retrieval-augmented generation (RAG) plus tool-using agents delivers that, but only with disciplined architecture. From the vantage point of an AI application development company, the winners separate prototyping from production: they standardize data pipelines, constrain prompts, measure quality continuously, and ship on a web stack the business already trusts. Below is the blueprint we use to turn experiments into durable systems without burning latency or budget.

Reference architecture: production-grade RAG

  • Ingestion & governance: batch and streaming connectors (S3, SharePoint, Jira), PII scrubbing, document dedupe, and lineage tracking. Version corpora via immutable snapshots tied to releases.
  • Indexing: chunk with structure-aware heuristics (headings, tables), 15-30% overlap, store embeddings in Pinecone/Weaviate/pgvector; keep BM25 for fallback. Maintain forward links for citations.
  • Retrieval: hybrid dense+lexical, optional reranking (Cohere, bge-reranker). Filter by ACL before the model sees text. Cache hot queries; refresh cold-start indexes incrementally.
  • Generation: system prompts enforce style, safety, and citation JSON. Use function calling to fetch missing fields. Prefer smaller, faster models with routing to bigger ones on ambiguity.
  • Feedback & evals: log prompts, contexts, and answers. Score with RAGAS and human review. Track latency, token spend, answer groundedness, and hallucination rate in Langfuse/Phoenix.

Serving and UX: ship it on Next.js

RAG shines when the UI is snappy and verifiable. A Next.js development company can wire server actions, edge routes, and streaming UIs so answers feel instant and auditable across devices and regions. Guardrails belong close to the user: enforce role-based context, redact uploads, and display citations inline with diff-highlights.

  • Stream token-by-token via Server-Sent Events; keep SSR for first paint, hydrate client components when answers arrive.
  • Terminate auth at the edge (JWT, mTLS); pass signed, least-privilege retrieval filters to the API, never raw user queries plus secrets.
  • Log conversation IDs and RAG contexts for replayable debugging; do not persist full prompts containing sensitive data unless redacted.
  • Support fallbacks: if retrieval fails, degrade to knowledge base search rather than free-form generation.

Agents on top of RAG

Agents become useful when they can take structured actions beyond chat. Start with a planner that grounds on retrieved docs, then limit tools to well-defined, reversible operations with idempotent APIs.

  • CRM updates: validate customer IDs via schema, fetch latest state, propose a diff, require human confirm for high-risk fields.
  • Ticket triage: classify with a small model, retrieve runbooks, create drafts in Jira with citations back to the exact paragraphs.
  • ETL triggers: when new documents land, kick off embeddings, policy checks, and canary rollouts before global index promotion.
  • Analytics Q&A: answer with metric lineage; if a metric is stale, the agent asks to refresh the data pipeline before responding.

Tooling that works in production

Pick boring tools that integrate. We see success with LangGraph for multi-step agents, LangChain or LlamaIndex for RAG plumbing, OpenAI/Claude/Mistral for models, and Pinecone, Weaviate, or pgvector for storage. Glue them with feature flags and typed schemas.

  • Observability: Langfuse or Phoenix for traces, token costs, and prompt diffs; export to your SIEM for compliance evidence.
  • Evals: RAGAS, G-Eval, and golden sets per domain. Gate releases on groundedness, citation accuracy, and answer completeness thresholds.
  • Safety: prompt injection filters, URL allowlists, and regex+AST guards around tool arguments. Disallow writing outside approved resources.
  • Performance: use smaller embedding models for recall (E5/bge-small), rerank precisely, and cache final answers with semantic keys in Redis.
  • Cost control: cap context length, compress with token merging, and batch retrieval. Sample only 1-5% of traffic for heavy evals.

Pitfalls to avoid

  • Index-once mentality: without incremental updates and lineage, your citations drift and trust evaporates.
  • Oversized chunks: long passages tank recall. Keep chunks small, overlap smartly, and preserve section headers.
  • Blind agent autonomy: tools without guardrails become chaos. Require confirmations, rate limits, and audit trails.
  • Prompt sprawl: many near-duplicates kill iteration. Centralize templates, version them, and A/B with feature flags.
  • Ignoring ACLs: never retrieve before access checks. Filter at query time and during hybrid reranking.
  • UI opacity: if users can’t see sources, they won’t trust answers. Inline citations and diffs are mandatory.

Three quick wins we’ve delivered

  • Finserv knowledge assistant: hybrid RAG over policies cut handle time by 37%. Next.js streaming UI with ACL-aware retrieval eliminated escalations while Langfuse alerts caught a prompt-injection attempt in staging.
  • SaaS support copilot: agents draft replies and Jira tickets. We gated dangerous actions behind human review, drove 21% ticket deflection, and held p95 latency under 1.4s using rerankers and caching.
  • Manufacturing search: RAG over manuals plus tool-calling to create work orders. Cost dropped 42% after switching to E5-small embeddings and selective large-model routing on ambiguous questions.
